How to improve your AI feature after it ships
Most AI products stagnate after launch. Here's the feedback loop that keeps your feature improving — logging, tagging outputs, finding failure patterns, and iterating on prompts.
The hardest part of building an AI feature isn't shipping it. It's what happens in the weeks after.
You spend days crafting a system prompt, testing edge cases, tuning the output format. You ship. Users start using it. And then — if you're like most builders — you more or less move on. Maybe you fix the obvious breakages. But the quiet failures, the outputs that were just a bit off, the use cases you didn't anticipate: those pile up in the dark, silently degrading trust.
The builders who end up with AI features that users love aren't the ones who got the prompt right on the first try. They're the ones who built a loop.
Log everything you can (before you need it)
The first mistake most teams make: they don't log AI interactions at all, or they log only enough for billing purposes.
You don't know what you'll need to debug until something breaks — and in AI products, it almost always breaks in ways you didn't predict. So the safest position is to log aggressively from day one, while you still can.
What to capture at minimum:
- The full prompt (system + messages), exactly as sent to the model
- The model's raw response, before any post-processing
- The model and parameters (temperature, model version, etc.)
- A session or conversation ID so you can reconstruct context
- A timestamp, so you can correlate failures with deploys

Hashing your system prompt (rather than storing it in full each time) keeps logs lean while still letting you pinpoint exactly when a prompt changed and what changed with it.
If you're handling sensitive data or operating in the EU, you'll need a retention policy and a redaction strategy. But the logging infrastructure should be in place before you have any of those conversations, not after something goes wrong.
Tag outputs as good or bad
Logs tell you what happened. Tags tell you how it went.
The simplest tagging system is a thumbs-up / thumbs-down widget next to AI outputs. Users can signal in one click when something felt wrong. This generates labeled data that costs you nothing to collect.
But user-reported signals have blind spots — people who bounce because an output was bad never stop to rate it. So layer in implicit signals too:
- Did the user copy the output? (likely good)
- Did they immediately edit it? (mixed)
- Did they delete it and retype from scratch? (bad)
- Did they retry the same prompt? (almost certainly bad)
The combination of explicit ratings and behavioral signals gives you a much richer picture than either alone. The goal isn't a perfect feedback dataset — it's a reliable "bad output" bucket you can dig into when you're ready to improve.
Find your failure patterns
Once you have a batch of flagged outputs, the real work begins: understanding why they failed.
Resist the urge to look at each one in isolation. The question you're asking is structural: is there a category of failure that keeps recurring? Some common ones:
- Format drift — the model ignores your specified output structure when the input is long or complex
- Context blindness — the model ignores earlier context in the conversation in favor of the most recent message
- Edge-case collapse — a specific input type (questions phrased a certain way, non-English input, embedded code) consistently produces weaker output
- Instruction conflict — your system prompt has a subtle contradiction that the model resolves differently in different contexts
Group your failures by pattern, not by example. Twenty individually distinct-looking failures might all be the same underlying problem. Fixing the root cause is infinitely more efficient than patching cases one by one.
Turn your failures into evals
This is the piece most builders skip — and it's the one that compounds over time.
Every failure pattern you identify is an opportunity to write an eval: a test that will catch that class of failure in the future. If you find that your model produces bullet-list output when a user asks a follow-up question (when it should produce prose), write a test that catches exactly that.

Close the loop: refine, test, ship
Now you can iterate with confidence.
You have a failure pattern. You have evals that reproduce it. You try a prompt change, run the evals, and check whether the regression is fixed — without introducing new ones. This is the loop that makes AI features actually get better over time, rather than just staying stuck at whatever quality level they launched with.
A few things that make this process less painful in practice:
- Version your prompts alongside your code. A change to your system prompt is a code change — it should go through review and be tracked in version history. Prompt versioning for production code walks through a practical setup for this.
- Keep your eval suite small enough to run on every deploy. If it takes ten minutes, you won't run it. Fifteen focused tests beat a hundred slow ones every time.
- Ship prompt changes incrementally. A/B test when you can. If your user base is large enough, roll out the new prompt to 10% of users before committing fully.
The engineers who build reliable AI features don't get the prompt right on the first try — they get better at finding what went wrong and fixing it before users notice the pattern.
The loop is the product
Most AI features ship at roughly 70% of their potential. The remaining 30% lives in the feedback loop — in the observations you collect, the patterns you notice, the evals you build, and the prompt changes you make month after month.
The difference between an AI feature that users grow to trust and one they quietly stop using often comes down to this: did the team treat shipping as the finish line, or as the starting gun?
Build the logging infrastructure. Build the tagging layer. Build the eval suite. Not because you'll need them on day one — but because when you do need them, and you will, you'll already have the data waiting for you.
